This phase will focus on translating the qualitative demands of the PSI theory into a quantitative reward signal suitable for an RL agent. Each of the core PSI demands will be defined as a differentiable function Rdemand(s, a, s'), where the reward is contingent on the transition from state s to state s' resulting from action a.
Concrete formalizations will be grounded in the principles outlined in the source literature. For example:
- Certainty Demand: The reward R__certainty will be proportional to the reduction in the agent's uncertainty about the environment's dynamics. Echoing the concept of "reinforcement driven information acquisition" (Schmidhuber et al.), this can be quantified by measuring the change in entropy (or a similar information-theoretic measure) of the agent's internal world model following a state transition. An action that leads to a more predictable state will yield a positive certainty reward.
- Competence Demand: The reward R__competence will be a direct function of the agent's ability to successfully execute its intentions. It will increase when an action leads to an expected outcome and decrease when the outcome is unexpected or constitutes a failure. This directly models the competence estimate calculation described in the PSI theory, where success reinforces the agent's belief in its own efficacy.
The final intrinsic reward signal at time t, Rt, will not be a scalar but a weighted vector: Rt = [w1Rintegrity, w2Rcertainty, w3Rcompetence, ...]. The weights (w__i) will not be static; instead, they will be dynamically modulated by the current urgency of each corresponding demand, as specified in the PSI model. An agent low on fuel will thus heavily weight rewards related to finding energy, while a sated and safe agent may prioritize rewards related to certainty or competence. To resolve the mismatch with standard RL algorithms, which expect a scalar reward, the Action-Learning Layer will project this vector into a scalar r__t for each learning update. This projection will be a weighted sum, r__t = w ⋅ Rt, where the weight vector w is determined by the agent's current motivational state as calculated in the Cognitive-Motivational Layer.
4.2 Phase 2: Dynamic Adaptation of RL Parameters via Cognitive Modulators
This phase will develop the mechanism for integrating PSI's cognitive modulators into the RL learning process. The values of the four modulators—Activation, Resolution Level, Selection Threshold, and Securing Threshold—will be calculated at each time step based on the state of the demand system, as described by Dörner. These values will then be used to adapt core RL parameters through a set of explicit functional mappings.
- Exploration Rate (ε): The exploration rate ε will be modeled as a function of the Securing Threshold and Resolution Level. High uncertainty about the environment will increase the securing threshold, which in turn will lead to a higher ε and more exploratory, information-gathering behavior. Similarly, high activation (and thus a low resolution level) will also increase ε, modeling the impulsive, less-planned actions characteristic of a high-arousal state.
- Learning Rate (α): The learning rate α will be modeled as a function of Activation. A higher activation level, indicating a more urgent or critical situation, will increase the learning rate to facilitate rapid adaptation to new information.
- Discount Factor (γ): The discount factor γ will be modeled as a function of the Selection Threshold. A high selection threshold, indicating a strong focus on the current motive, will result in a higher γ. This makes the agent more farsighted and prioritizes long-term goal achievement, whereas a low threshold (distractibility) will lower γ, making the agent more opportunistic.
4.3 Phase 3: The PSI-RL Agent Architecture
The prototype agent, PSI-RL, will be implemented with a two-layer architecture that separates motivational regulation from action learning.
- Cognitive-Motivational Layer: This top layer takes the agent's current state and history as input. It runs the PSI-derived computations to update the levels of all physiological, cognitive, and social demands. Based on these levels, it determines the current modulator values and computes the multi-dimensional intrinsic reward vector Rt for the current time step.
- Action-Learning Layer: This bottom layer consists of an RL agent. We propose Modular Least Squares Policy Iteration (M-LSPI) as a primary candidate algorithm, as its regional decomposition of the state space provides a natural architectural correlate to the context-switching driven by the PSI-based motivational system. It receives the state s__t and the projected scalar reward r__t from the layer above. It uses the modulator values (Activation, Selection Threshold, etc.) to dynamically set its internal learning parameters (α, γ, ε) for that time step. It then uses this configuration to update its value function and selects the next action a__t.
4.4 Phase 4: Experimental Evaluation
The final phase will consist of a rigorous empirical evaluation of the PSI-RL agent's performance and behavior.
- Environment: We will use a simulated environment based on the "city world" described in the PSI literature (Hille, 1997). This environment includes resources (fuel, water), hazards (damaging streets), and dynamic conditions (e.g., changing roadblocks). Its complexity makes it an ideal testbed for evaluating an agent's ability to balance competing physiological demands (fuel), safety demands (intactness), and cognitive demands (certainty about the map).
- Baseline for Comparison: The PSI-RL agent will be benchmarked against a traditional Q-learning agent. To provide a fair comparison, the baseline agent will be given a single, carefully hand-crafted reward function that combines extrinsic rewards for finding resources with negative penalties for taking damage.
- Evaluation Metrics: The evaluation will be two-fold, assessing both quantitative performance and qualitative behavior.
- Quantitative Performance: We will measure and compare key performance indicators such as survival time, total resources gathered per epoch, and the time required to complete specific tasks within the simulation.
- Qualitative Behavioral Analysis: We will analyze the emergent behaviors of the PSI-RL agent to determine if it exhibits more adaptive and "intelligent" strategies.
